Training a Reinforcement Learning Agent for Single-Asset Order Execution
Summary
This QlibRL example describes how to configure and run a reinforcement learning workflow for executing orders in one asset. The training setup defines a simulator with 30-minute steps, a categorical action space, a full-history state representation, a penalty for concentrating volume in a short period, a recurrent network, and a PPO policy. It also specifies data inputs, worker settings, training iterations, validation, and checkpoint storage.
A separate backtest configuration sets the order file, trading window, market data features, price and volume limits, and strategies for 30-minute TWAP or the learned policy. The document provides launch instructions and explains that developers can replace the simulator, interpreters, reward, or policy through configuration. It is an implementation example rather than evidence of trading performance: no comparative results or execution-quality measurements are reported. Its settings and sample data paths are specific to the example, and the future portfolio-construction example is only mentioned as planned work.
Key ideas
- The example frames single-asset execution as a reinforcement learning task with configurable states, actions, rewards, and policies.
- The sample agent uses PPO with a recurrent network and a categorical action interpreter.
- The reward penalizes large volumes executed over a short period.
- A separate backtest configuration specifies trading hours, price rules, volume limits, and strategy selection.
- The document gives a configurable workflow but reports no evidence of execution performance.

# Local path to the latest model. The model is generated during training, so please run training first if you want to run backtest with a trained policy. You could also remove this parameter file to run backtest with a randomly initialized policy.

With the above config files, you can start training the agent by the following command:
.. code-block:: console
$ python -m qlib.rl.contrib.train_onpolicy.py --config_path train_config.yml
After the training, you can backtest with the following command:
.. code-block:: console
$ python -m qlib.rl.contrib.backtest.py --config_path backtest_config.yml
In that case, :class:`~qlib.rl.order_execution.simulator_qlib.SingleAssetOrderExecution` and :class:`~qlib.rl.order_execution.simulator_simple.SingleAssetOrderExecutionSimple` as examples for simulator, :class:`qlib.rl.order_execution.interpreter.FullHistoryStateInterpreter` and :class:`qlib.rl.order_execution.interpreter.CategoricalActionInterpreter` as examples for interpreter, :class:`qlib.rl.order_execution.policy.PPO` as an example for policy, and :class:`qlib.rl.order_execution.reward.PAPenaltyReward` as an example for reward.
For the single asset order execution task, if developers have already defined their simulator/interpreters/reward function/policy, they could launch the training and backtest pipeline by simply modifying the corresponding settings in the config files.
The details about the example can be found `here <https://github.com/microsoft/qlib/blob/main/examples/rl/README.md>`_.
In the future, we will provide more examples for different scenarios such as RL-based portfolio construction.Shown in full with attribution under the source's licence. Licence: MIT
